Hybrid knowledge-tracing model outperforms baselines in cultural-education dialogue study

A multidimensional knowledge tracing hybrid model integrating semantics and dialogue behavior for cultural education

A model that combines open-response language analysis, dialogue behavior and multidimensional concept memory achieved an area under the curve of 0.905 in a study of cultural-education knowledge tracing. Researchers trained and tested the improved SAINT+–DKVMN system on interaction logs from three universities and two municipal museums, reporting overall prediction accuracy of 0.862 (95% confidence interval 0.856–0.868) and AUC of 0.905 (0.899–0.912).

The study corpus contained approximately 8,000 students, 12,000 dialogue sessions and 120,000 interaction events, including about 60,000 open-ended responses. It combined classroom and homework logs from three Chinese universities with educational-tour dialogue logs from two museums. The dataset covered 15,000 exercises and 200 concept tags; 10,000 responses received human rubric annotations and 8,500 received argument-strength annotations.

The proposed model has four main components. A domain-fine-tuned RoBERTa encoder represented students’ responses, while dialogue actions, speaking roles, prompt counts and response time were combined with those semantic representations to form structured learning events. A dual-stream SAINT+ transformer then modeled question context and response history. An extended Dynamic Key-Value Memory Network maintained concept-level states across factual understanding, explanatory ability, reflective depth and confidence, with dialogue-conditioned write gates controlling memory updates.

Data were divided 70/15/15 into training, validation and test sets by student identifier, ensuring that an individual student’s interactions appeared in only one subset. The researchers used five random seeds, reported means and standard deviations, and selected hyperparameters on validation data. About 18% of test time points in the multidimensional ability evaluation used values interpolated between nearby labeled observations. Confidence was primarily based on students’ immediate self-assessments, which had a completion rate of approximately 82.4%, and was therefore evaluated separately from teacher-rated dimensions.

The full model was compared with conventional knowledge-tracing systems, including BKT, DKT, AKT, DKVMN, SAINT+ and GKT, as well as text-augmented versions of several baselines. SAINT+ achieved an AUC of 0.861 (0.854–0.868), while the full hybrid reached 0.905 (0.899–0.912). With the same RoBERTa encoding, the hybrid outperformed RoBERTa+SAINT+ in accuracy, AUC, PR-AUC, concept-level RMSE and teacher agreement; paired tests over five runs reported p<0.01 for differences in AUC and concept RMSE.

Across the four ability dimensions, the model reported RMSE values from 0.09 to 0.11 and R² values of 0.78 for factual understanding, 0.80 for explanatory ability, 0.76 for confidence and 0.74 for reflective depth. For open-ended responses, the study reported approximately 0.877 overall rubric-classification accuracy. Argument-strength predictions had a mean absolute error of 0.086, mean squared error of 0.0114 and R² of 0.889. These metrics describe agreement with the study’s annotated labels and do not by themselves establish human-equivalent scoring or classroom effectiveness.

In a six-week randomized classroom experiment, 18 classes at the three universities were assigned by class to model-assisted feedback or standard feedback, with nine classes in each condition. The analysis estimated approximately 400 students per group and used a linear mixed-effects model to account for class clustering. The experimental group’s mean mastery gain was 0.128, compared with 0.064 in the control group, and the reported difference was associated with a moderate effect size of 0.45. Four-week retention scores were 0.722 and 0.670, respectively. The researchers described these naturalistic results as associative and acknowledged that they do not prove strict causal inevitability.

Counterfactual tests provided limited evidence about which model signals mattered. Masking the most highly weighted tokens reduced AUC by 0.030 and produced a 7.8% prediction-flip rate, compared with 0.008 and 2.1% for random deletion. Disabling the memory write gate reduced AUC by 0.041 and increased prediction flips to 11.2%. Attention weights and write-gate magnitudes showed only moderate alignment with Integrated Gradients rankings, which the authors interpreted as partial rather than complete causal fidelity of the explanations.

Several limitations constrain the findings. The primary data came from Chinese-language cultural courses and museum tours at a limited number of institutions, and some ability labels were interpolated. The full model also increased computational cost relative to a RoBERTa+SAINT+ baseline, although a compressed version with 146 million parameters retained an AUC of 0.898. External evaluation on two English-language datasets showed lower zero-shot transfer and improved results after fine-tuning on 10% of target data, supporting limited cross-language transfer rather than universal generalization. The study did not systematically assess fairness across student subgroups, and performance was reported to decline for new students with fewer than about 10 prior interactions.
